https://arxiv.org/abs/2608.17950(opens in a new tab)Large Language Models (LLMs) demonstrate remarkable multi-hop reasoning capabilities over long contexts, yet the internal mechanisms enabling these distant cognitive leaps remain poorly understood. Traditional attention-based interpretability often fails to capture true semantic proximity due to routing artifacts like attention sinks. In this paper, we bypass attention weights to directly analyze the dynamic geometry of the hidden state manifold, proving that deep LLM latent spaces natively organize into Small-World networks. In brief
Deep layers of a transformer, not its early layers, are where a long context becomes a navigable graph: sparsify the hidden-state cosine similarity matrix and the most semantically unrelated tokens in a passage sit within 6 hops of each other. Early syntax layers connect them 0% of the time.
The setup: 1000 wikitext-2 paragraphs of 150-300 tokens, with source and target anchors chosen by an external judge (all-MiniLM-L6-v2) to minimize cosine similarity subject to at least 20 tokens of separation, then BFS over the thresholded token-token graph. Models are Qwen2.5-1.5B (layers 2, 24) and Phi-3-Mini-4k-Instruct (layers 2, 30), with a threshold sweep over 0.75-0.91.
Connectivity snaps on abruptly: Qwen goes from 0.0% at 0.85 to 7.5% at 0.81 to 48.5% at 0.75; Phi-3 reaches 12.3% at 0.85 and 42.0% at 0.81. Where paths exist, average hops stay under 6 (4.93 for Qwen, 3.60 for Phi-3 at 0.81). A layer sweep shows near-zero connectivity through layer 12, then 12.3% at 16 and 92.4% at 24. Varying separation from 10 to 250 tokens moves average hops only from 3.84 to 5.31.
Evidence is measured, with 2 architectures, a layer-wise ablation, and a separation ablation. The RAG hallucination application is weaker: connectivity drops to 14.8% and 18.2% under unanswerable distractor prompts with L over 7, and a topological classifier reaches AUROC 0.89 on Qwen, but baseline numbers for perplexity and lexical grounding are not reported, and "unanswerable distractor" is a proxy for hallucination rather than the real thing.
Boundaries: 1.5B-8B models only, contexts up to 300 tokens, and the 0.81 threshold is empirical and may shift with embedding dimension or normalization.
If you work on interpretability or hallucination detection, this offers a cheap geometric probe worth trying, but not yet a validated detector.
