https://arxiv.org/abs/2609.07370(opens in a new tab)Resource constrained single-board computers including Raspberry Pi, NVIDIA Jetson Nano, Arduino UNO Q, Orange Pi, and LattePanda motivate on-device small language model (SLM) agents that reduce cloud dependence, improve data locality, and tolerate intermittent connectivity. Model Context Protocol (MCP)-style tool invocation demands more than fluent generation: an agent must emit machine-readable JSON, select the correct tool, supply all required arguments, and avoid unintended actions. We establish a platform-agnostic CPU baseline by evaluating five open-weight models below two billion paramet
In brief
Sub-2B models that score well on JSON tool calling do so only because a recovery parser strips away surrounding prose and Markdown fences: across 1,000 generations, just 5 complete raw responses parsed as JSON directly.
The SLM-ToolCall-100 benchmark gives 100 prompts across 5 mock tools (get_weather, search_web, calculate, send_email, create_todo) to Phi-1.5, Pythia-1.4B-deduped, TinyLlama-1.1B-Chat, Qwen2.5-0.5B and Qwen2.5-1.5B, under greedy decoding and nucleus sampling (temperature 0.7, p = 0.9), FP32 on CPU. Each prompt states the intended tool and every argument value, so the task is copying and serialization, not planning.
Qwen2.5-1.5B sampling led at 79% recovered calls (95% CI 70.0%-85.8%), greedy 75%; Qwen2.5-0.5B fell from 72% greedy to 32% sampling. Phi-1.5 scored 0% in both conditions, Pythia and TinyLlama at or below 7%. Of 658 failures, 588 (89.4%) terminated at JSON recovery. Qwen2.5-1.5B greedy scored 100% on calculate, to-do and email but 0% on weather, from formatting alone.
Rates are measured with Wilson intervals and paired exact McNemar tests, but sampling was run once per prompt, so 75% versus 79% is not separable from run noise. Checkpoints mix base and chat-tuned models with no chat templates, so parameter count is confounded. The CPU probe used 3 prompts in a shared notebook process on unspecified hardware; RSS orderings are not monotonic in parameters. No quantisation, no execution, no distractor tools, no edge board tested.
Treat reported tool-call accuracy for small models as a property of the parser plus model, and measure strict validity separately.
